Reproducibility Instructions

Installing requirements

This project was tested with Python 3.10 on Windows and Linux.
There are three options to install the requirements.

  1. Build a Docker container with the provided Dockerfile.
  2. Build a Singularity container with the provided definition file mtl.def.
  3. Install the requirements to your local Python environment with pip install -r requirements.txt.

Meta-Dataset Acquisition

To reproduce the acquisition of the meta-dataset, follow the instructions below.
This includes downloading, pre-processing, training, and evaluating all algorithms on all datasets.
An HPC cluster is recommended for this task as this requires a significant amount of computational resources.
For convenience, the meta-dataset is already included in the repository, so these steps are not necessary to reproduce only the algorithm selection results.

  1. Download the source file from the link in the dataset table and place it in the data_sets/<data_set_name>/source/files/ directory and remove the placeholder file in that directory.
  2. Convert the raw data to the processed data.
    1. To run on HPC: run hpc_convert_raw_to_processed.py.
    2. To run locally: run convert_raw_to_processed.py --data_set_name <data_set_name> for each data_set_name in hpc_data_set_names.data_set_names.
  3. Convert the processed data to the atomic data.
    1. To run on HPC: run hpc_convert_processed_to_atomic.py.
    2. To run locally: run convert_processed_to_atomic.py --data_set_name <data_set_name> for each data_set_name in hpc_data_set_names.data_set_names.
  4. Train all algorithms on all datasets.
    1. To run on HPC: run hpc_execute.py --mode fit.
    2. To run locally: run execution_master.py --mode fit --data_set_name <data_set_name> --algorithm_name <algorithm_name> --algorithm_config <algorithm_config> --fold <fold> for each data_set_name in hpc_data_set_names.data_set_names for each algorithm_name in hpc_data_set_names.algorithm_names for each algorithm_config retrieved by calling algorithm_config.retrieve_configurations(algorithm_name) for each fold in [0,1,2,3,4].
  5. Create predictions with all algorithms on all datasets.
    1. To run on HPC: run hpc_execute.py --mode predict.

  7. Run aggregate_results.py to aggregate the results of the evaluations of all algorithms on all datasets.
  8. Run create_meta_dataset.py to create the meta-dataset from the aggregated results.

Algorithm Selection

These steps involve training and evaluating the meta-learning algorithms on the meta-dataset to select the best-performing algorithms.
An HPC cluster is recommended for this task as this requires a significant amount of computational resources.

  1. Make sure that the meta-dataset for the desired target metric is in the algorithm_selection/ directory, e.g., the file [email protected].
  2. Train and evaluate the meta-learning algorthms on the meta-dataset.
    1. To run on HPC: run algorithm_selection/hpc_mtl.py
    2. To run locally: run algorithm_selection/process_evaluation.py --metric NDCG@10 --split loo --eval_id <eval_id> --objective <objective> --multi_labels 0 --algo_id <algo_id> --model <model> for each eval_id in range(72) for each objective in ["regression", "ranking"] for each algo_id in range(46) for each model in ["linear_regression", "k_nearest_neighbors", "xgboost", "random_forest", "autogluon", "autogluon_best", "autogluon_best_opt"].
  3. Run algorithm_selection/aggregate_results.py to aggregate the results of the evaluations of the meta-learning algorithms on the meta-dataset.
  4. Run algorithm_selection/evaluate_meta_learning.py to evaluate the meta-learning algorithms.
  5. Run algorithm_selection/plot_meta_learning.py to create the plots presented in the paper.

Meta-Dataset for NDCG@10

This is the meta-dataset for the NDCG@10 metric.
The first twelve columns contain the meta-features and the remaining columns contain the algorithm performances in NDCG@10.
The integer in the name of each algorithm is the ID of the hyperparameter configuration of that algorithm.
Refer to algorithm_config.py for the hyperparameters.
The content of this file is stored in algorithm_selection/metaset_NDCG@10.
The meta-datasets for other metrics are also stored there.
